The paper proposes a unified negative pair generation (UNPG) method to improve face recognition performance. The key insights are:

  1. From a unified perspective, classification loss (CL) and metric loss (ML) have the same goal of approaching a well-discriminative feature space (WDFS), but differ in their pair generation (PG) strategies.

  2. CL and ML suffer from a mismatch between the similarity distributions of the sampled pairs and all negative pairs, which prevents the formation of WDFS.

The UNPG method combines MLPG and CLPG strategies to alleviate this mismatch. It also includes filtering out noise-negative pairs (too-easy and too-hard) to ensure reliable convergence and improved performance.

Experiments show that UNPG helps achieve state-of-the-art performance on various face recognition benchmarks when applied to recent loss functions like CosFace, ArcFace, and MagFace. The analysis demonstrates that UNPG reduces the overlap between positive and negative similarity distributions, bringing the feature space closer to the ideal WDFS.
