Harnessing Human Feedback for Instructional Visual Editing

Temel Kavramlar
Incorporating human feedback improves instructional image editing models significantly.
Özet

This paper introduces HIVE, a framework that leverages human feedback to enhance instructional visual editing. The framework collects human feedback on edited images to capture user preferences and uses scalable diffusion model fine-tuning methods to incorporate this feedback. Extensive experiments show that HIVE outperforms previous state-of-the-art models by a large margin. The paper also discusses the challenges, methodology, experiments, ablation studies, and limitations of the approach.

İstatistikler
We present a new 1.1M training dataset, a 3.6K reward dataset, and a 1K evaluation dataset. HIVE is favored over previous state-of-the-art instructional image editing approaches by a large margin. The reward model Rϕ(˜x, c) reflects human preferences for edited images.

How can the biases inherited from pre-trained models be mitigated in HIVE?

In HIVE, biases inherited from pre-trained models can be mitigated through several strategies: Red Teaming: By incorporating red teaming practices, where a separate team actively seeks to identify and counteract biases in the model, HIVE can reduce the impact of inherited biases. Diverse Training Data: Ensuring that the training data used for fine-tuning the model is diverse and representative can help mitigate biases. This can involve collecting data from a wide range of sources and ensuring balanced representation. Regular Auditing: Regularly auditing the model's outputs and performance can help identify and address biases as they arise. This ongoing monitoring can help maintain fairness and accuracy in the model's predictions. Bias Detection Algorithms: Implementing bias detection algorithms within the model architecture can help flag instances where biases are present, allowing for corrective measures to be taken. Human Oversight: Incorporating human oversight and intervention in the model's decision-making process can provide an additional layer of bias mitigation, as humans can identify and correct biased outputs.

What are the limitations of using human feedback in instructional image editing?

While human feedback is valuable in instructional image editing, it comes with certain limitations: Subjectivity: Human preferences and interpretations can be subjective, leading to variations in feedback that may not always align with the intended outcome. Scalability: Collecting and incorporating human feedback can be time-consuming and resource-intensive, making it challenging to scale the process for large datasets or real-time applications. Bias: Human annotators themselves may introduce biases into the feedback, impacting the model's training and performance. Ambiguity: Instructions provided by humans can sometimes be ambiguous or unclear, leading to challenges in accurately interpreting and implementing the desired edits. Consistency: Ensuring consistency in human feedback across different annotators can be difficult, potentially resulting in inconsistencies in the model's training data.

How can the training data generation process be improved to handle diverse and ambiguous scenarios in editing instructions?

To improve the training data generation process for handling diverse and ambiguous scenarios in editing instructions in HIVE, the following strategies can be implemented: Cycle Consistency Augmentation: Introducing cycle consistency augmentation can help generate additional training data by inverting bi-directional mappings of variables, enabling the model to learn from diverse scenarios. Data Augmentation Techniques: Implementing data augmentation techniques such as rotation, scaling, and translation can help create a more diverse set of training examples, allowing the model to learn from a wider range of scenarios. Incorporating Real-World Data: Including real-world images and instructions in the training data can expose the model to a variety of editing scenarios encountered in practical applications. Red Team Testing: Conducting red team testing, where a separate team actively tries to break the model with diverse and ambiguous instructions, can help identify weaknesses in the training data generation process and improve its robustness. Continuous Feedback Loop: Establishing a continuous feedback loop with human annotators and users can provide insights into the model's performance on diverse scenarios, allowing for iterative improvements in the training data generation process.
